Introduction
Attention is a technique in machine learning that allows a model to focus on specific parts of an input while making predictions. Attention mechanisms enable models to selectively focus on certain parts of an input sequence - making them useful in tasks involving sequential or structured data. Attention models have become increasingly popular over the last few years, particularly in natural language processing (NLP). At their core, attention allows the model to dynamically weigh the importance of different input parts rather than simply using static representations.
Background
Traditional machine learning models typically process and transform an entire input sequence into a fixed-size representation that can then be used for prediction. Unfortunately, this approach has several drawbacks, particularly when dealing with long sequences or irrelevant information. Attention mechanisms aim to address these drawbacks by enabling models to focus only on relevant portions of an input sequence.
How Attention Works in NLP Models
In Natural Language Processing (NLP), attention is often employed in sequence-to-sequence (seq2seq) models that translate text from one language to another or generate written material given a prompt. In these models, the input usually consists of words and the output follows suit with another set of words. With attention, however, the model can focus on different parts of this input sequence when making predictions for each output word.
The attention mechanism works by first encode the input sequence into a fixed-length vector, which serves as the context vector for making predictions for each output word. This context vector is constructed by taking a weighted sum of hidden states from the input sequence, with weights determined by an attention function.
The attention function is used to calculate the importance of each input word for a given output word. It can be implemented using various techniques, such as dot-product attention, multi-head attention and self-attention.
Types of Attention Mechanisms
Literature has suggested several types of attention mechanisms, including additive attention, multiplicative attention and dot product attention. These systems differ in how they compute attention weights - which determine the importance of each element in an input sequence - to prioritize certain elements over others.
Additive attention involves computing attention weights by applying a learned weight matrix to an intersection of the current input and a context vector that summarizes previous states of the model. Multiplicative attention, on the other hand, involves taking the dot product of both current input and a learned weight matrix representing context vector as its attention weight. Dot product attention is simply another variant of multiplicative attention that uses this same dot product as its attention factor.
Applications of Attention Mechanisms
Attention mechanisms have been employed in a variety of machine learning tasks, such as language modeling, machine translation, image captioning and speech recognition. Natural language processing has seen attention mechanisms improve model performance by allowing the model to focus on important parts of an input sequence like important words or phrases. Machine translation models use attention mechanisms for alignment between source and target sequences which allows them to produce more accurate translations. Computer vision models utilize attention mechanisms to focus on specific regions of an image for more precise image captions.
