Introduction

A Tensor Processing Unit (TPU) node is a specialized hardware accelerator designed to significantly accelerate machine learning workloads. Developed by Google, TPUs are optimized for tensor processing, which is the foundational mathematical operation in various machine learning frameworks such as TensorFlow. By providing dedicated hardware for these calculations, TPUs enable faster training and inference of machine learning models compared to traditional CPUs and GPUs.

Architecture

First Generation TPU

The first generation of TPUs, released in 2015, focused primarily on accelerating neural network inference. This generation featured an 8-bit integer (INT8) matrix multiplication unit for performing low-precision arithmetic, which was sufficient for inference tasks. The first generation TPU was also equipped with 24 MiB of on-chip memory for storing weights and activations.

Second Generation TPU

The second generation TPU, also known as the TPU v2, was introduced in 2017. This iteration expanded the TPU's capabilities to include machine learning model training in addition to inference. It featured a 16-bit floating-point (bfloat16) arithmetic unit to facilitate higher-precision calculations required for training. The TPU v2 also included 64 GB of high-bandwidth memory (HBM), allowing it to process larger datasets and models more efficiently.

Third Generation TPU

Google introduced the TPU v3 in 2018, which featured significant enhancements to its architecture. The TPU v3 doubled the matrix multiplication unit's size, enabling it to process 128x128 matrix multiplications. It also increased the HBM capacity to 128 GB, providing additional memory for handling larger models and datasets. Furthermore, the TPU v3 integrated a water-cooling system to maintain optimal thermal conditions during high-performance workloads.

Applications

TPUs have been utilized in various machine learning applications, ranging from image recognition to natural language processing. Some notable examples include:

  • AlphaGo: Google DeepMind's AlphaGo, which defeated the world champion Go player, employed TPUs for training and executing its neural networks.
